From the early 2000s when Google first applied online A/B testing to improve products, the technique has matured over nearly 20 years, becoming a cornerstone for data‑driven decision making across internet and other industries.

The widespread adoption brings two layers of challenges: (1) business‑process challenges such as risk, cost, benefit, and team collaboration; (2) technical challenges that include experiment accuracy, scientific analysis, and efficiency.

Challenge 1: Experiment Accuracy – Four key directions are discussed: optimizing random traffic grouping (both high‑traffic and low‑traffic scenarios), improving precision through variance reduction and traffic increase, eliminating hidden effects (social network, latency, novelty, primacy, spillover), and reliable estimation of short‑term and long‑term effects using statistical tests (t‑test, U‑test, non‑parametric, Bayesian) and handling multiple comparisons and conflicting metrics.

Challenge 2: Experiment Analysis & Interpretation – Emphasizes validating experiment processes, matching hypotheses with data, and applying heterogeneous treatment effect (HTE) analysis. Techniques such as stratified grouping, regression, machine learning, propensity scoring, Bayesian methods, uplift curves, and AUUC are highlighted for assessing impact.

Challenge 3: Experiment Efficiency – Improves efficiency by enhancing data quality, monitoring pipelines, detecting anomalies, and optimizing traffic usage to shorten experiment duration, especially for large‑parameter or slow‑converging experiments.
